SHAP

SHAPを使用して機械学習モデルの予測を説明・監査します。SHAP ExplainerとMaskerの選択、特徴量重要度の計算と検証、マルチ出力の説明、局所的・大域的なSHAP可視化の生成を行います。

SHAP とは?

このスキルは、SHAPライブラリ(バージョン0.52.0、Python 3.12以降が必要)を用いて機械学習モデルの予測を説明するための手順を提供します。ユーザーは、最新の`shap.Explanation` APIを活用し、説明対象の出力や背景分布を明示的に指定した上で、各説明の加法性(additivity)を検証しながら解釈を行うことができます。サポートするプラットフォームはPython環境であり、ツリーモデル、線形モデル、ニューラルネットワーク、テキスト・画像モデルなど多様なモデルに対応しています。スキルは、ExplainerとMaskerの選択ガイド、標準的なワークフロー、可視化手法、トラブルシューティング手順、そして公平性評価やコホート分析などの応用的なタスクをカバーしています。SHAPはあくまでモデルの振る舞いを記述するものであり、因果関係や公平性を直接的に示すものではないことを明確にし、結果と共に限界を報告することを推奨しています。

# SHAP

SHAPを使用して、適合済み予測モデルが入力を出力にマッピングする方法を記述します。最新の `shap.Explanation` API を使用し、説明対象の出力と背景分布を明示的に指定し、解釈の前に各説明を検証します。

このスキルは **SHAP 0.52.0**(2026-05-28 リリース)に対応しています。このリリースには Python 3.12 以降が必要です。

## 運用ルール

1. 固定された評価済みモデルを説明します。SHAPを予測検証の代わりとして使用しないでください。
2. 説明には保持データまたは明確にラベル付けされた分析行を使用します。背景行は適切な学習母集団または参照母集団からのみ選択します。
3. 説明対象の出力(回帰値、生のマージン、確率、対数損失、ロジット、またはその他のモデル手法)を明記します。
4. 説明は `shap.Explanation` オブジェクトとして保持します。`explainer(X)` を呼び出し、レガシーコードを保守する場合にのみ `.shap_values(X)` を使用します。
5. マルチ出力モデルの場合、表形式のプロットを使用する前に1つの出力を選択します:`explanation[..., output_index]`。
6. `base_values + values.sum(...)` を説明対象の正確なモデル出力と照合します。
7. SHAPをマスキング/背景選択下でのモデル動作の記述として扱います。因果関係、公平性、救済策、科学的メカニズムを確立するものではありません。
8. 入力形状、前処理、モデルバージョン、出力空間、行の順序を確認するまで、加法性の失敗を黙殺しないでください。
9. 信頼できないpickle、joblib、モデル、または説明アーティファクトをロードしないでください。これらの形式は逆シリアル化中にコードを実行する可能性があります。

## インストール

分離された環境を作成し、ドキュメント化されたリリースを固定します:

```bash
uv venv --python 3.12
source .venv/bin/activate
uv pip install "shap[plots]==0.52.0"
shap[plots] はプロットの依存関係をインストールします。プロジェクトと互換性のあるバージョンで、適合済みモデルのパッケージを追加します。古いPythonとの互換性については、references/migration.md を参照してください。異なるSHAPリリースを静かにインストールしないでください。
APIの不一致をデバッグする前に、環境を確認します:
import platform
import shap
print("Python:", platform.python_version())
print("SHAP:", shap.__version__)
標準ワークフロー
1. 説明ターゲットを定義する
以下を記録します:
  • モデルと前処理のバージョン
  • 説明対象の正確な呼び出し可能オブジェクトまたはモデルメソッド
  • 出力名/インデックスと単位
  • 評価行
  • 背景/参照母集団
  • マスカーと説明アルゴリズム
  • SHAPとモデルライブラリのバージョン
分類器の場合、タスクが生のマージンか確率を必要とするかを決定します。デフォルトはモデルファミリーによって異なります。プロットの色や符号から単位を推測しないでください。
2. ExplainerとMaskerを選択する
自動ディスパッチで十分な場合は shap.Explainer(model, masker) から始めます。その仮定や出力制御が重要な場合は、専門の説明器をインスタンス化します。
状況推奨選択肢重要な制約
サポートされているツリーアンサンブルTreeExplainermodel_output="probability" と "log_loss" には介入的マスキングと背景データが必要
線形モデルLinearExplainerマスカーが介入的動作と相関認識動作を決定
小さな特徴空間ExactExplainer特徴数が制約されていないとコストが急増
一般的な表形式の呼び出し可能オブジェクトPermutationExplainer少なくとも1回の完全な順方向/逆方向パーミュテーションの予算を確保
階層的な特徴グループ、テキスト、画像PartitionExplainer分割ツリーが協力ゲームを変更
微分可能なニューラルネットワークDeepExplainer または GradientExplainerフレームワークのサポート、出力形状、背景選択のテストが必要
レガシーKernel SHAPワークフローKernelExplainer通常、モデル固有の手法よりもはるかに低速
詳細な決定ガイドは references/explainers.md を参照してください。特徴量が相関、構造化、スパース、または意味的にグループ化されている場合は、references/data-maskers.md を使用します。
3. 最新の Explanation を計算する
この完全な二値分類の例では、明示的な背景を使用し、陽性クラスの出力を選択します:
import numpy as np
import shap
from sklearn.datasets import load_breast_cancer
from sklearn.ensemble import RandomForestClassifier
from sklearn.model_selection import train_test_split
X, y = load_breast_cancer(as_frame=True, return_X_y=True)
X_train, X_test, y_train, y_test = train_test_split(
    X,
    y,
    test_size=0.2,
    stratify=y,
    random_state=7,
)
model = RandomForestClassifier(
    n_estimators=200,
    min_samples_leaf=3,
    random_state=7,
    n_jobs=-1,
).fit(X_train, y_train)
background = shap.sample(X_train, 100, random_state=7)
explainer = shap.Explainer(model, background, algorithm="tree")
all_outputs = explainer(X_test)
# sklearnのツリー分類器はクラスごとに1つの出力を公開します。
positive = all_outputs[..., 1]
assert positive.values.shape == X_test.shape
reconstructed = np.asarray(positive.base_values) + positive.values.sum(axis=1)
expected = model.predict_proba(X_test)[:, 1]
np.testing.assert_allclose(reconstructed, expected, rtol=1e-5, atol=1e-6)
shap.plots.beeswarm(positive, max_display=15)
shap.plots.waterfall(positive[0], max_display=15)
出力形状はモデルに依存します:
  • 1つの表形式出力:(サンプル数, 特徴数)
  • 複数の表形式出力:(サンプル数, 特徴数, 出力数)
  • 複数のモデル入力:多くの場合、配列または説明のリスト
  • 画像/テキスト説明:特徴軸は入力表現に従い、存在する場合は最終軸で出力選択を行います。
最新のマルチ出力配列に対して、pre-0.45のパターン values[class_index] は使用しないでください。values[..., class_index] を使用するか、Explanation 自体をスライスします。
4. 必要に応じてツリー出力のセマンティクスを制御する
サポートされているツリー分類器の場合、確率空間の説明は明示的である必要があります:
background = shap.sample(X_train, 200, random_state=7)
explainer = shap.TreeExplainer(
    model,
    data=background,
    feature_perturbation="interventional",
    model_output="probability",
)
probability_exp = explainer(X_test)
SHAP 0.52では:
  • feature_perturbation="auto" は、背景データが提供された場合は介入的セマンティクスを、そうでない場合はツリーパス依存セマンティクスを使用します。
  • 確率と対数損失の出力モードは、介入的セマンティクスでのみサポートされます。
  • 低忠実度のツリー近似を意図的に使用する場合は、approximate=True を explainer(X, approximate=True) に渡します。コンストラクタには渡さないでください。
5. モデル非依存の呼び出し可能オブジェクトを意図的に使用する
解釈される出力の正確な呼び出し可能オブジェクトを渡します:
masker = shap.maskers.Independent(background, max_samples=100)
explainer = shap.Explainer(
    model.predict_proba,
    masker,
    algorithm="permutation",
    output_names=[str(label) for label in model.classes_],
    seed=7,
)
budget = 2 * X_test.shape[1] + 1
all_outputs = explainer(X_test.iloc[:20], max_evals=budget)
positive = all_outputs[..., 1]
推定値が不安定な場合は、max_evals を増やしてより多くのパーミュテーションを平均します。シード、背景サンプル、評価予算をレポートに含めます。
6. 利用可能なプロットだけでなく、質問を可視化する
質問プロット
どの特徴量が平均的に最大の属性規模を持つか?shap.plots.bar(exp)
方向、規模、観測値はどのように大域的に変化するか?shap.plots.beeswarm(exp)
なぜある予測がベースラインと異なるのか?shap.plots.waterfall(exp[i])
ある特徴量の属性はその値に対してどのように変化するか?shap.plots.scatter(exp[:, feature])
説明はサンプルレベルのパターンを形成するか?shap.plots.heatmap(exp)
事前定義されたコホートは記述的にどのように異なるか?shap.plots.bar(exp.cohorts(labels).abs.mean(0))
どのトークンまたは画像領域が出力に寄与するか?shap.plots.text(exp) または shap.plots.image(exp)
図のカスタマイズや保存の前に references/plots.md を参照してください。
7. 結果と共に限界を報告する
最低限、以下を報告します:
  • 出力と単位
  • ベースライン/参照母集団
  • 説明器とマスカー
  • サンプル数と選択方法
  • 出力インデックス/名前
  • 加法性誤差または該当する近似診断
  • 既知の相関/グループ化された特徴量
  • 結果が局所的か、集約的か、コホート固有か
  • 因果関係を否定する明確な記述
一般的なタスク
大域的および局所的分析
大域的なプロットを使用して重要なパターンを見つけ、散布図でそれらのパターンを検査し、局所的なプロットで選択された行を調査します。選択ルールを文書化せずに、視覚的に劇的な行のみを選択しないでください。
マルチクラスモデル
可能な場合は output_names を設定し、explanation.output_names を検査し、プロットの前に出力をスライスします:
class_exp = explanation[..., "class_name"]
# または
class_exp = explanation[..., class_index]
クラス間で符号付き属性を平均化しないでください。クラス間比較の場合は、同じモデル、行、背景、出力空間、集約を維持します。
コホート、サブグループ分析、公平性
SHAPはモデルがコホート間で特徴量をどのように使用するかを比較できますが、これは公平性テストではありません。SHAP値が小さい保護特徴量は、代理差別を排除せず、保護特徴量を削除しても公平性が確立されません。属性分析をパフォーマンス、キャリブレーション、エラー率、およびドメイン適切な公平性メトリクスと組み合わせてください。
コホート構築、モデル比較、エラー分析、対数損失説明、モニタリング、およびプロダクションレコードについては、references/workflows.md を参照してください。
テキストと画像
トークンやピクセルを通常の独立した列として扱うのではなく、ドメインマスカーを使用します:
  • shap.maskers.Text(tokenizer) と PartitionExplainer をトークングループに使用
  • shap.maskers.Image(...) と PartitionExplainer を画像領域に使用
  • outputs=... で高コストなマルチ出力モデルを制限
現在の例と出力形状のガイダンスについては、references/modalities.md を参照してください。
トラブルシューティングの順序
  1. Python、SHAP、モデルライブラリ、NumPy、フレームワークのバージョンを出力します。
  2. モデルがフィッティング時に使用されたものとまったく同じ変換済み列、順序、dtype、欠損値表現を受け取っていることを確認します。
  3. values.shape、base_values.shape、data.shape、feature_names、output_names を出力します。
  4. 選択された出力と出力単位を確認します。
  5. 同じ行で同じ順序で予測を再計算します。
  6. より小さなバッチと代表的な背景をテストします。
  7. その後にのみ、パッケージ固有の互換性や近似設定を調査します。
加法性の失敗、形状の不一致、カテゴリカル特徴量、パイプライン、ディープラーニングフレームワーク、プロット、パフォーマンスについては、references/troubleshooting.md を参照してください。
バンドルスクリプト
決定論的で自己完結型の表形式の例を実行し、重要度データ、メタデータ、プロットを書き出します:
uv run --no-project --python 3.12 --with "shap[plots]==0.52.0" \
  skills/shap/scripts/tabular_report.py --output-dir /tmp/shap-report
このスクリプトはデータをダウンロードしたり、モデルを逆シリアル化したりしません。テンプレートとして読み、出力選択と加法性検証を維持しながら、組み込みのデータセットとモデルを置き換えます。
